Minimizing Material Waste and Energy Consumption in 3D Printing Using Multi-Objective Machine Learning Optimization

يمكن لتقنية نمذجة الترسيب المنصهر (Fused Deposition Modeling - FDM) أن تقلل من فاقد مواد القطع، إلا أنها لا تزال تستهلك الطاقة الكهربائية ومواد الدعم (Support Material) التي تُزال بعد الطباعة. تهدف هذه الدراسة إلى تطوير منهجية متعددة الأهداف تعتمد على التعلم الآلي لاختيار أوضاع الطباعة الأكثر كفاءة في استخدام الموارد. واعتمدت الدراسة على مجموعة البيانات العامة r3DiM، التي تضم 184 سجلًا لطباعة مادة PET-G موزعة على 68 مكونًا ميكانيكيًا. وقد اختُبر لكل مكون اتجاهان أو ثلاثة اتجاهات للطباعة مع تثبيت جميع إعدادات الطابعة. وتم قياس إجمالي استهلاك الطاقة الكهربائية تجريبيًا، في حين استُخدم برنامج PrusaSlicer لتقدير كتلة خيوط مادة الدعم المستهلكة. واستُخدمت أربعة عشر خاصية هندسية وما قبل الطباعة لتدريب سبعة نماذج انحدار مختلفة. كما استُخدم أسلوب تحقق متكرر قائم على تجميع المكونات لضمان عدم انتقال اتجاهات المكون نفسه بين مجموعات التدريب والاختبار. وقد حقق نموذج XGBoost أفضل أداء في التنبؤ باستهلاك الطاقة، حيث بلغ متوسط الجذر التربيعي لمتوسط مربع الخطأ (RMSE) 9.174 واط·ساعة، بينما وصل متوسط معامل التحديد (R²) إلى 0.969 عبر جميع طيات التحقق. أما نموذج Extra Trees فقد كان الأفضل في التنبؤ بكمية مادة الدعم المهدرة، محققًا قيمة RMSE بلغت 0.656 غرام ومتوسط R² قدره 0.768. بعد ذلك، استُخدم اختيار باريتو (Pareto) المعتمد على التنبؤات المتقاطعة لتقييم جميع اتجاهات الطباعة المتاحة لكل مكون غير مرئي مسبقًا. وأظهرت النتائج أن الاتجاهات المختارة خفّضت متوسط استهلاك الطاقة بنسبة 5.44% مقارنةً بالاتجاه المرجعي القريب من الصفر درجة، مع فترة ثقة بطريقة Bootstrap بنسبة 95% تراوحت بين 3.06% و8.04%. في المقابل، بلغ متوسط التوفير في مادة الدعم −0.020 غرام، وهو فرق غير ذي دلالة إحصائية. كما أن 11.8% فقط من المكونات حققت تحسنًا متزامنًا في هدفي تقليل استهلاك الطاقة وتقليل مادة الدعم. وتوضح هذه النتائج أن ارتفاع دقة
